In the slide deck, we describe how graph databases are used at Netflix. Graph databases can be faster than relational databases for deeply-connected data - a strength of the underlying model. We have used JanusGraph on top of Cassandra. Both technologies are Open Source.

Data Lakes have been built with a desire to democratize data - to allow more and more people, tools, and applications to make use of data. A key capability needed to achieve it is hiding the complexity of underlying data structures and physical data storage from users. The de-facto standard has been the Hive table format addresses some of these problems but falls short at data, user, and application scale. So what is the answer? Apache Iceberg. Apache Iceberg table format is now in use and contributed to by many leading tech companies like Netflix, Apple, Airbnb, LinkedIn, Dremio, Expedia, and AWS. Learning is an analytic process of exploring the past in order to predict the future. Hence, being able to travel back in time to create features is critical for machine learning projects to be successful. To enable this, we built a time machine that computes features for any arbitrary time in the recent past for offline experimentation. We also built a real-time stream processing system to capture the interests of members during different times of the day and to quickly adapt to changes in the collective interests of members as it happens in case of real-world events. Building the time machine for offline experimentation and the real-time infrastructure for online recommendations with Apache Spark (Streaming) and Apache Cassandra empowered us to both scale up the data size by an order of magnitude and train and validate the models in less time. We will delve into the architecture, use case details, data models used for cassandra and share our learnings. About the Speakers Prasanna Padmanabhan Engineering Manager, Netflix Prasanna leads the Data Systems for Personalization team at Netflix. His primary focus is on building various big data infrastructure components that help their algorithmic engineers to innovate faster and improve personalization for Netflix members. In the past, he has built distributed data systems that leverages both batch and stream processing. Roopa Tangirala Engineering Manager, Netflix Roopa Tangirala is an experienced engineering leader with extensive background in databases, be they distributed or relational. She manages the database engineering team at Netflix responsible for operating cloud persistent and semipersistent runtime stores for Netflix, which includes Cassandra, Elasticsearch, Dynomite and MySQL databases, by ensuring data availability, durability, and scalability to meet the growing business needs.

This talk is an introduction to the vector search engine Weaviate. You will learn how storing data using vectors enables semantic search and automatic data classification. Topics like the underlying vector storage mechanism and how the pre-trained language vectorization model enables this are touched. In addition, this presentation consists of live demos to show the power of Weaviate and how you can get started with your own datasets. No prior technical knowledge is required; all concepts are illustrated with real use case examples and live demos. Most of all data is unstructured. Additionally, data is often stored without context, meaning and relation to concepts in the real world. This means that all this data is difficult to index, classify and search through. While this is traditionally solved by manual effort or expensive machine learning models, Weaviate takes another approach to this problem. Weaviate is a vector search engine, which stores data as vectors and automatically adds context and meaning to new data. This enables to search through the data without using exact matching keywords. Moreover, data can be automatically classified. Weaviate is completely open source, has a built-in machine learning model, has a graph-like data model, completely API-based and is cloud-native. Weaviate uses a GraphQL API next to RESTful endpoints to interact with the data in an intuitive manner. Additionally, Python, Go and JavaScript clients are available to facilitate interaction between Weaviate and your applications. GraphQL and client examples will be shown in the presentation.

At Netflix, we try to provide the best personalized video recommendations to our members. To do this, we need to adapt our recommendations for each contextual situation, which depends on information such as time or device. In this talk, I will describe how state of the art Contextual Recommendations are used at Netflix. A first example of contextual adaptation is the model that powers the Continue Watching row. It uses a feature-based approach with a carefully constructed training set to learn how to adapt to the context of the member. Next, I will dive into more modern approaches such as Tensor Factorization and LSTMs and share some results from deployments of these methods. I will highlight lessons learned and some common pitfalls of using these powerful methods in industrial scale systems. Finally, I will touch upon system reliability, choice of optimization metrics, hidden costs, risks and benefits of using highly adaptive systems.

Complex event processing (CEP) is about identifying business opportunities and threats in real time by detecting patterns in data and taking appropriate automated action. Example business use cases for CEP include location-based marketing, smart inventories, targeted ads, Wi-Fi offloading, fraud detection, churn prediction, fleet management, predictive maintenance, security incident event management, and many more. While Spark Streaming provides a distributed resilient framework for ingesting events in real time, effort is still needed to build CEP applications. This is because CEP use cases require correlation of events, which in turn requires us to treat every incoming event as a discrete occurrence in time. Spark Streaming treats the entire batch of events as single occurrence. Many CEP use cases also require alerts to be fired even when there is no incoming event. An example of such use case is to fire an alert when an order-shipped event is NOT received within the SLA times following an order-received event. At Oracle we have adopted a few neat techniques like running continuous query engines as long running tasks, using empty batches as triggers, etc. to bring complex event processing to Spark Streaming. Airbnb has a wide variety of ML problems ranging from models on traditional structured data to models built on unstructured data such as user reviews, messages and listing images. The ability to build, iterate on, and maintain healthy machine learning models is critical to Airbnb’s success. Many ML Platforms cover data collection, feature engineering, training, deploying, productionalization, and monitoring but few, if any, do all of the above seamlessly. Bighead aims to tie together various open source and in-house projects to remove incidental complexity from ML workflows. Bighead is built on Python and Spark and can be used in modular pieces as each ML problem presents unique challenges. Through standardization of the path to production, training environments and the methods for collecting and transforming data on Spark, each model is reproducible and iterable. This talk covers the architecture, the problems that each individual component and the overall system aims to solve, and a vision for the future of machine learning infrastructure. It’s widely adapted in Airbnb and we have variety of models running in production. We have seen the overall model development time go down from many months to days on Bighead. We plan to open source Bighead to allow the wider community to benefit from our work.

Spark and GraphX in the Netflix Recommender System: We at Netflix strive to deliver maximum enjoyment and entertainment to our millions of members across the world. We do so by having great content and by constantly innovating on our product. A key strategy to optimize both is to follow a data-driven method. Data allows us to find optimal approaches to applications such as content buying or our renowned personalization algorithms. But, in order to learn from this data, we need to be smart about the algorithms we use, how we apply them, and how we can scale them to our volume of data (over 50 million members and 5 billion hours streamed over three months). In this talk we describe how Spark and GraphX can be leveraged to address some of our scale challenges. In particular, we share insights and lessons learned on how to run large probabilistic clustering and graph diffusion algorithms on top of GraphX, making it possible to apply them at Netflix scale.

Modern machine learning (ML) workloads, such as deep learning and large-scale model training, are compute-intensive and require distributed execution. Ray is an open-source, distributed framework from U.C. Berkeley’s RISELab that easily scales Python applications and ML workloads from a laptop to a cluster, with an emphasis on the unique performance challenges of ML/AI systems. It is now used in many production deployments. This talk will cover Ray’s overview, architecture, core concepts, and primitives, such as remote Tasks and Actors; briefly discuss Ray native libraries (Ray Tune, Ray Train, Ray Serve, Ray Datasets, RLlib); and Ray’s growing ecosystem. Through a demo using XGBoost for classification, we will demonstrate how you can scale training, hyperparameter tuning, and inference—from a single node to a cluster, with tangible performance difference when using Ray. Cloud database vendors tend to report performance numbers for the sweet spot or running in highly optimized hardware with specific workload parameters. Moreover, many of these systems are not tested under different failure scenarios that may appear in the public cloud. At Netflix, as a cloud-native enterprise, our focus is on high availability. We achieve high availability by deploying at multiple regions. Hence, our data store system performance is highly affected by our global deployment model, instance types and workload patterns. Hence, we were interested in a Cloud database benchmark tool that could be deployed in a loosely-coupled fashion, as a microservice, and with the ability to dynamically change the configurations parameters at run time. In this paper, we present Netflix Data Benchmark (NDBench). NDBench offers pluggable patterns and loads and support for different client APIs. It offers the ability to deploy, manage and monitor multiple instances from a single point. NDBench was designed to run for infinite time. This nature offered us with the ability to test long-running database maintenance jobs, test database systems under conditions that affect the performance, such as compactions, repairs etc., and also gives us a view on client side issues like memory leaks and heap pressure. We have been running NDBench for almost 3 years having validated multiple database versions, tested numerous NoSQL systems running on the Cloud, and tested new functionalities. NDBench is major component of our testing and validation pipelines.

Netflix created and open sourced Dynomite project to provide reusable distributed database infrastructure that turns single server data stores into scalable, distributed databases. Dynomite supports pluggable protocols and pluggable storage engines, which allows us to add sharding and replication to a variety of non-distributed data stores. The entire database infrastructure can be reused across a variety of workloads from in-memory to on-disk, and across APIs from key/value to document databases. Dynomite allows application developers to choose the API that best fits their requirements, while DevOps can select the best operation database based on the workload. Dynomite is used by Netflix to handle millions of OPS in production leveraging Redis and RocksDB. In this talk, we are going to show how we achieved high availability by being able to terminate any Dynomite node without client side downtime, best practices and the challenges in deploying Dynomite in production.

Modern Vehicles are equipped with advanced sensing and communication technologies, which enable them to support services in Vehicular Internet of Things (IoTs) era such as autonomous driving. The communication in IoTs must be delay-aware, reliable, scalable and secure1,2 to prevent an attacker from injecting/manipulating messages; minimize the impact introduced by crypto operations. Existing crypto mechanisms introduce significant computation and bandwidth overhead, which creates critical safety problems. Research Objectives: Design new digital signatures that are ideal for delay-aware Vehicular IoTs; Using Mobile Multiprocessor Systems on Chip (MpSoC) integrated in vehicles; Evaluation via theoretical analysis, simulation, and deployment in actual vehicular networks at Purdue University airport.

JanusGraph is OSS. It is highly concurrent and it has support for ES and Cassandra. In Cassandra, we have great plugins developed for Datastax Java Driver. JanusGraph provides the ability to indexing with ES or Solr. ES is also heavily used at Netflix.

DAM is part of the content platform engineering. CPE deals with a lot of digital entities and assets. These entities needs to be shared across many microservices. We felt that the data can be modeled very well with a graph database. DAM stores the metadata for all the assets. The metadata can be connected or not. They metadata can be of different kind and potentially connected. The assets have to be searchable and the system has to be highly available. A simplified example of how the assets are stored in the database. The artwork is related to a movie or a person. The artwork is related to a movie, a person and a character. For example, the movies can be Jessica Jones, the person Krysten Ritter, and the character Jessica Jones. DAM uses tinkerpop API and Gremlin to query the data. The data are being stored in Cassandra. The movie could have different display sets based on the language. Each display set may have different entities, such subs/dubs.

Protego provides authorization as a service along with User and Partner Management service. Currently for some the api requirements indexes and inverted indexes are managed in C* DB. Based on future api requirements (support for TTL and entities) and relationships between some of the concepts graph db can prove to be good underlying storage. By moving to graph db managing relationships between objects will become easy as well as queries and index management to support existing and future api requirements. Salp, our distributed tracing solution, was initially developed by the Runtime platform team. The primary goal was data collection from various services and providing a proof of concept visualization. Later on, the services - Crawler, Aggregator, Backend API were added to enrich the data and allow querying. Dredge wants to identify networks dependencies. This can assist when network events happen and can significantly reduce our mean to detection. #core team would probably be the consumer of this service, which is named Kevin.
