This document discusses Pinterest's data architecture and use of Pinball for workflow management. Pinterest processes 3 petabytes of data daily from their 60 billion pins and 1 billion boards across a 2000 node Hadoop cluster. They use Kafka, Secor and Singer for ingesting event data. Pinball is used for workflow management to handle their scale of hundreds of workflows, thousands of jobs and 500+ jobs in some workflows. Pinball provides simple abstractions, extensibility, reliability, debuggability and horizontal scalability for workflow execution.

An Introduction to Graph Databases

Many ecommerce companies have extensive logs of user behavior such as clicks and conversions. However, if supervised learning is naively applied, then systems can suffer from poor performance due to bias and feedback loops. Using techniques from counterfactual learning we can leverage log data in a principled manner in order to model user behaviour and build personalized recommender systems. At Grubhub, a user journey begins with recommendations and the vast majority of conversions are powered by recommendations. Our recommender policies can drive user behavior to increase orders and/or profit. Accordingly, the ability to rapidly iterate and experiment is very important. Because of our powerful GPU workflows, we can iterate 200% more rapidly than with counterpart CPU workflows. Developers iterate ideas with notebooks powered by GPUs. Hyperparameter spaces are explored up to 8x faster with multi-GPUs Ray clusters. Solutions are shipped from notebooks to production in half the time with nbdev. With our accelerated DS workflows and Deep Learning on GPUs, we were able to deliver a +12.6% conversion boost in just a few months. In this talk we hope to present modern techniques for industrial recommender systems powered by GPU workflows. Recommendation systems today are widely used across many applications such as in multimedia content platforms, social networks, and ecommerce, to provide suggestions to users that are most likely to fulfill their needs, thereby improving the user experience. Academic research, to date, largely focuses on the performance of recommendation models in terms of ranking quality or accuracy measures, which often don’t directly translate into improvements in the real-world. In this talk, we present some of the most interesting challenges that we face in the personalization efforts at Netflix. How to build a recommender system?

Learning is an analytic process of exploring the past in order to predict the future. Hence, being able to travel back in time to create features is critical for machine learning projects to be successful. To enable this, we built a time machine that computes features for any arbitrary time in the recent past for offline experimentation. We also built a real-time stream processing system to capture the interests of members during different times of the day and to quickly adapt to changes in the collective interests of members as it happens in case of real-world events. Building the time machine for offline experimentation and the real-time infrastructure for online recommendations with Apache Spark (Streaming) and Apache Cassandra empowered us to both scale up the data size by an order of magnitude and train and validate the models in less time. We will delve into the architecture, use case details, data models used for cassandra and share our learnings. About the Speakers Prasanna Padmanabhan Engineering Manager, Netflix Prasanna leads the Data Systems for Personalization team at Netflix. His primary focus is on building various big data infrastructure components that help their algorithmic engineers to innovate faster and improve personalization for Netflix members. In the past, he has built distributed data systems that leverages both batch and stream processing. Fast-growing startups usually face a common set of challenges when employing machine learning. Data scientists are expected to work on new products and develop new models as well as iterate on existing ones. Once in production, models should be continuously monitored and regularly maintained as the infrastructure evolves. Before too long, data scientists end up spending most of their time doing maintenance and firefighting of existing models instead of creating new ones. At GetYourGuide, we faced these challenges and decided to think about machine learning development holistically, which led us to our machine learning platform. Our platform uses MLflow to keep track of our machine learning life-cycle and ease the development experience. To integrate our models into our production environment, we also need to deal with additional requirements like API specification, SLOs and monitoring. To empower our data scientists, we have built a templating system that takes care of the heavy lifting of going to production, leveraging software engineering tools and ML-specific ones like BentoML. The online advertising industry is based on identifying users with cookies, and showing relevant ads to interested users. But there are many data providers, many places to target ads and many people browsing online. How can we identify users across data providers? The first step in solving this is by cookie mapping: a chain of server calls that pass identifiers across providers. Sadly, chains break, servers break, providers can be flaky or use caching and you may never see the whole of the chain. The solution to this problem is constructing an identity graph with the data we see: in our case, cookie ids are nodes, edges are relations and connected components of the graph are users. In this talk I will explain how Hybrid Theory leverages Spark and GraphFrames to construct and maintain a 2000 million node identity graph with minimal computational cost.

On the other hand the data set sizes and volumes are also growing exponentially compounding the complexity of data processing pipelines.There exists a need for true low latency streaming coupled with very high throughput data processing. Apache Apex as a low latency and high throughput data processing framework and Apache Kudu as a high throughput store form a nice combination which solves this pattern very efficiently. This session will walk through a use case which involves writing a high throughput stream using Apache Kafka,Apache Apex and Apache Kudu. The session will start with a general overview of Apache Apex and capabilities of Apex that form the foundation for a low latency and high throughput engine with Apache kafka being an example input source of streams. Subsequently we walk through Kudu integration with Apex by walking through various patterns like end to end exactly once, selective column writes and timestamp propagations for out of band data. The session will also cover additional patterns that this integration will cover for enterprise level data processing pipelines.
